MLOps Engineer's Guide to LLMOps


Most LLMOps articles treat the “Ops” part as an afterthought, a checklist bolted onto the end of a model card. This one takes the opposite approach: it starts with what production ML engineering already knows how to do, then asks precisely where those practices break when you introduce a language model, and what you do instead.

This post outlines the architectural patterns, governance strategies, and implementation details required to transition from isolated experiments to secure, scalable business engines. Specifically, it covers the distinctions between traditional MLOps and emerging LLMOps, automated observability patterns, and the integration of agentic workflows within enterprise governance.

Every section in this article follows the same shape: what MLOps does well, where that breaks under LLM conditions, and what the adapted practice looks like in code. If you work in classical ML and are moving toward LLM infrastructure, this structure should let you map new concepts onto things you already trust.

The examples throughout reference Databricks (Unity Catalog, MLflow, Mosaic AI) as one concrete implementation. The patterns translate directly to Vertex AI, SageMaker, or a self-managed stack, and tooling substitutions are noted where the choice is non-trivial.


Setting the Frame: What Actually Changes

Before getting into individual pillars, it helps to be precise about where the disciplines genuinely diverge, not at the level of marketing copy, but at the level of which engineering decisions change:

1. Evaluation

What MLOps does

Classical ML evaluation is straightforward in principle: hold out a labelled test set, run predictions, compare against ground truth. Accuracy, precision, recall, and AUC are computed deterministically. A model is better or worse than its predecessor by a measurable margin.

Automated evaluation gates in CI/CD pipelines make this reliable at scale. You train, score against a fixed benchmark, and promote or block based on a threshold. Human review is exceptional, not routine.

Where it breaks for LLMs

The ground truth assumption collapses. A customer support response can be factually correct but tone-deaf. A summarisation can be fluent but subtly hallucinated. BLEU and ROUGE, the metrics borrowed from machine translation and summarisation research, measure n-gram overlap against a reference string. They penalise creative but accurate paraphrasing, reward verbatim repetition (even if the repeated text is wrong), and have no concept of factual grounding.

More fundamentally: for many LLM tasks, no reference string exists. There is no “correct” answer to retrieve and compare against. The evaluation problem is not a measurement problem, it is a definition problem.

What LLMOps does instead

LLM-as-Judge routes outputs through a separate, stronger model with a structured scoring rubric. The judge evaluates dimensions independently: faithfulness to retrieved context, relevance to the question, absence of unsupported claims.

Two important caveats. First, judge models are biased, they favour verbose responses and outputs from models in the same family. Calibrate your judge against a human-labelled golden set before trusting it at scale. Second, LLM-as-judge adds latency and cost to every evaluation run, sample strategically rather than scoring every prediction.

Human evaluation pipelines remain irreplaceable for high-stakes domains. Build a lightweight labelling interface, route a stratified sample of production traffic through human review weekly, and use the results to continuously calibrate your judge. Human labels are the ground truth your automated system should converge toward, not a fallback when automation fails.

2. Versioning

What MLOps does

In traditional ML, the versioning unit is the model artifact: weights, hyperparameters, and the training data snapshot that produced them. MLflow, DVC, and similar tools track experiments automatically. Reproducing a prior result means pointing at a run ID and restoring the checkpoint. Promotion from staging to production is gated on metric thresholds evaluated against that artifact.

This is well understood and, in most organisations, largely solved.

Where it breaks for LLMs

A system prompt is not documentation. It is executable code. Changing three words in a system prompt can shift model behaviour as dramatically as a full weight update, altering refusal patterns, response format, citation behaviour, and tone simultaneously. Yet in most teams, prompts live in Notion pages, spreadsheets, or worse, hardcoded strings in application code.

The consequence is invisible deployments. Engineers update a prompt, observe a change in user behaviour, and have no way to correlate cause and effect because the prompt change was never recorded as a deployment event. Rollbacks are manual and error-prone.

A subtler problem: the model, the prompt, and the retrieval configuration form a coupled system. A prompt written for claude-sonnet-3.7 may produce subtly different results on claude-sonnet-4.6. Model version upgrades, even patch releases, should trigger prompt re-evaluation, not just regression tests on weight-level behaviour.

Treat prompts as versioned, deployable artifacts with their own CI/CD gates:

Store these files in version control alongside your application code. Tag each prompt with the model version it was validated against. Gate promotion on eval scores, the same way you gate model checkpoints on accuracy thresholds. When a prompt or model version changes, re-run your full evaluation suite before promoting.

In practice, this means your deployment pipeline has two separate promotion gates: one for model weight changes, one for prompt changes. Both should require the same rigour.


3. Data Quality and Drift Detection

What MLOps does

Classical drift detection operates on structured features. Schema validation compares column names and types between training and production data sources. Statistical tests quantify whether feature distributions have shifted: Chi-square for categoricals, Population Stability Index (PSI) for numerics. When drift exceeds a threshold, retraining is triggered automatically.

PSI is typically preferred over raw statistical tests for numerics because it yields a continuous severity score:

This works reliably when inputs are tabular: age, income, product category, transaction amount.

Where it breaks for LLMs

LLM inputs are free text. There is no schema to validate, no numeric distribution to bucket, no categorical frequency to chi-square test. A user population that shifts from asking product questions to asking legal questions represents massive semantic drift, but PSI on raw token counts would not detect it. The feature space is effectively unbounded.

A second failure: even when inputs are stable, retrieval drift can silently degrade output quality. If your vector index grows stale, documents updated in the source system but not re-embedded, the model receives outdated context and hallucinates against it. Classical drift monitoring has no concept of retrieval staleness.

What LLMOps does instead

Embedding-space drift brings statistical rigour back by projecting inputs into a measurable space. Rather than testing raw text, embed incoming queries and compare the centroid and spread of production embeddings against a reference window:

Retrieval staleness monitoring tracks the age of documents being returned by the vector index. If the median freshness of retrieved chunks degrades past your SLA, trigger a re-indexing job, not a retraining job:

Alert fatigue is real. Use a two-window strategy: flag at PSI > 0.1 or centroid similarity < 0.9, trigger retraining at PSI > 0.2 or similarity < 0.85, and require the threshold to persist across N consecutive evaluation windows before initiating a full retraining run.

4. Feature Stores and Retrieval

What MLOps does

Feature stores solve a specific and well-defined problem: training/serving skew caused by inconsistent feature transformations. If the pipeline that computes customer_lifetime_value during training uses a different lookback window than the one running at inference time, your model silently operates on a different distribution than it was trained on.

The solution is to compute features once, store them centrally, and have both training and serving pipelines read from the same versioned table. This eliminates the divergence.

Where it breaks for LLMs

For LLMs, the analogous problem is not a feature transformation mismatch, it is a retrieval and context mismatch. The “features” fed to an LLM are retrieved chunks of text. If the retrieval logic, the embedding model, or the underlying document corpus differs between the time a prompt was developed and the time it runs in production, the model receives different context and produces different outputs.

Classic feature stores have no answer for this. They were not built to version retrieval configurations or track embedding model changes.

What LLMOps does instead

Treat the retrieval pipeline as the feature store equivalent. Version the embedding model, the chunking strategy, and the index configuration alongside the prompt that consumes them:

When you change any dimension of this config, embedding model, chunk size, top-k, treat it as a deployment event. Re-run your evaluation suite against the new retrieval config before promoting. The prompt that was written for 512-token chunks may degrade meaningfully when you move to 1024.

When the overhead is not worth it: A centralised retrieval config is valuable when multiple teams or products share the same index. For single-team applications with a stable corpus, this level of versioning may be overkill. Evaluate the cost of the governance against the frequency with which your retrieval config actually changes.


5. Observability

What MLOps does

Classical ML observability monitors three things: prediction distributions (is the model outputting plausible values?), feature distributions (is the input data healthy?), and endpoint health (latency, error rate, throughput). Dashboards aggregate these signals, and alerts fire when thresholds are breached.

This works because a prediction is atomic. You send a request, receive a number or a class label, and that single output is the unit of observation.

Where it breaks for LLMs

An LLM agent is not atomic. A single user request may trigger a planning step, three tool calls, a validation step, and a synthesis step, each with its own latency, token cost, and failure mode. If the final response is wrong or expensive, classical observability tells you only that the endpoint returned a 200. The root cause is hidden somewhere in the middle of that execution chain.

The failure mode this produces is particularly insidious: agents enter tool call loops. The agent plans a query, retrieves partial results, plans a refinement, retrieves again, and cycles, because its termination condition is ambiguous. Without step-level tracing, you see a timeout. With it, you see exactly where the loop began.

What LLMOps does instead

A step-wise tracing framework maps every user request to a structured execution trace, with each phase captured independently:

When circuit_breaker: triggered appears in your run metadata, you know immediately that the agent looped, without log excavation.

Two hard problems that step-wise tracing does not yet solve cleanly:

  • Parallel agent branches: When an agent spawns sub-agents concurrently, correlating traces across branches requires distributed trace IDs. Most MLflow setups do not support this natively; OpenTelemetry propagation is the more robust path at this scale.
  • Per-tenant cost attribution: Token costs in multi-tenant systems require tagging at the span level by user context, then aggregating, not just summing per run.

6. Governance and Security

What MLOps does

Governance in classical MLOps centres on access control and audit trails. A centralised data catalog (Unity Catalog or equivalent) enforces role-based permissions on datasets and model artifacts. Every training run, data access event, and deployment is logged. Regulatory frameworks like GDPR and HIPAA are satisfied through data residency controls and retention policies.

This is mature infrastructure. Most enterprise ML platforms have solved it at the storage and compute layers.

Where it breaks for LLMs

Two new attack surfaces emerge that classical governance was not designed to handle.

First, logs now contain free text. In a traditional ML pipeline, logs contain structured metadata: timestamps, feature values, prediction scores. In an LLM pipeline, logs contain user queries, retrieved document chunks, and model responses — all of which may include Personally Identifiable Information. A user asking “what is my policy for John Smith at 42 Oak Street” has just written PII into your inference log. Manual inspection does not scale.

Second, prompt injection is a new class of attack with no classical ML analogue. Malicious content embedded in retrieved documents or user inputs can hijack agent behaviour, instructing the model to ignore its system prompt, exfiltrate data, or take unintended actions. This is not a model quality problem; it is a security problem that must be addressed at the pipeline level.

What LLMOps does instead

PII scrubbing should run as a modular step in the logging pipeline, before logs are written to any persistent store:

Log entity types (PERSON, PHONE_NUMBER, EMAIL), not the values themselves. This gives you a compliance audit trail, “PII detected in request at 14:32 UTC, scrubbed before storage”, without persisting the sensitive data.

Prompt injection detection requires a dedicated validation step before retrieved content is inserted into the prompt context. The simplest effective pattern is a secondary classification/rule-based call that checks retrieved chunks for instruction-like patterns before they reach the main model:

This is one of the many approaches to prompt injection detection and enforcing security in LLM pipelines. My team was working on a natural language query engine for analytics support and had to implement harmful SQL generation detection before sending it to the database. We always don’t have to resort to building these features ourselves, we can also leverage open source tools like Guardrails to achieve similar results.


7. Deployment and Retraining

What MLOps does

Classical deployment follows a well-established pattern: train a candidate model, evaluate it against a holdout set, compare against the production incumbent, canary-deploy to a slice of traffic, and graduate to full traffic after metrics clear. If something goes wrong, roll back to the previous checkpoint.

Retraining is triggered by one of three signals: accuracy degrades below a threshold, statistical drift is detected in the input distribution, or a scheduled retraining interval elapses.

This is robust and well-understood.

Where it breaks for LLMs

Rollback breaks first. When your model is a fine-tuned checkpoint you control, rolling back means re-deploying a prior artifact. When your model is a third-party API (GPT-4o, Claude, Gemini, etc.), you do not control the weights. The provider may update the underlying model without announcing it. “Rollback” now means pinning to a specific API version if the provider supports it, or switching to a prior prompt configuration if they do not. Many teams discover this the hard way after a silent model update degrades their product.

Retraining breaks second. Fine-tuning a large model is expensive, in time, compute, and iteration cost. The classical pattern of “drift detected → retrain → redeploy” is too expensive to run on the cadence that LLM quality requires. And crucially, for prompt-engineered systems, retraining may not be the right lever at all. The model is not wrong; the prompt or retrieval configuration is.

What LLMOps does instead

Separate deployment gates for prompts and models. Prompt changes and model changes should be independent deployment events, each with their own evaluation gate:

Model version pinning should be explicit in your deployment config, not assumed:

When the provider releases a new model version, treat it as a candidate deployment: run your full evaluation suite against the new version with your current prompts, compare against the incumbent, and only migrate if scores are stable or improved.

I learned it hardway in a project, where timelines were being pushed because business users were not accepting the new model, after User Acceptance Testing (UAT). In MLOps we have evaluation suites that decide the fate of model promotion, but in LLMs it requires the business to approve too.


Conclusion

The through-line across every section of this article is the same: LLMOps does not replace MLOps. It inherits it, and then adapts each practice to handle what is structurally different about language models, the absence of ground truth, the presence of free text at every layer, the coupling between model, prompt, and retrieval, and the loss of control that comes with third-party model APIs.

The adaptations follow a consistent pattern. When a classical tool fails, you do not abandon it, you find the right projection that makes it applicable again. Structured feature drift → embedding-space drift. Model artifact versioning → prompt and retrieval config versioning. Prediction observability → step-wise execution tracing. Access-controlled logs → PII-scrubbed, injection-audited logs.

What this article cannot give you are the specific thresholds, traffic volumes, and failure modes from your own production system. The most valuable knowledge in LLMOps is not architectural, it is empirical, hard-won, and specific to your domain. Treat this as a framework, not a recipe.

In one of my projects, we had built a RAG system for analytics use case. The Agentic system latency, with ~11 steps with retrival, validation, planning and tool calling for complex queries was P95 around ~3-5 minutes, which was too high for business users. And user, not having experience with LLM Agentic systems, was not willing to accept that it is normal for them. When we checked the individual step latency, it became very apparent that the bootleneck was the Data Warehouse settings at the client end.
